Description

Supersedes #19326.

CuTe DSL GEMM/BMM runners enumerate up to ~2,000 tactics per GEMM shape (CTA tile × cluster × split-K × rasterization × swizzle × A/B swap × prefetch × scheduler), and the AutoTuner JIT-compiles and profiles every candidate on a cold start. This PR lets nvMatmulHeuristics (nvMMH) pick the kernel configurations: nvMMH-aware runners build their tactic list from the top max_tactics configurations that nvMMH ranks for each problem instead of enumerating their full tactic space.

Enabling nvMMH

nvMMH guidance is off by default. To enable it, add the policy to extra_llm_api_options.yaml:

autotuner_nvmmh_config:
  max_tactics: 5 # nvMMH kernel configurations profiled per GEMM/BMM shape (default 5)

or pass LLM(..., autotuner_nvmmh_config=AutoTunerNvMMHConfig(max_tactics=5)). max_tactics counts kernel configurations, not profiled tactics: each configuration expands into one tactic per combination of the knobs nvMMH does not model (see How it works), so a shape can profile several times max_tactics tactics.

Runners fall back to their full tactic list when the option is unset, when nvidia-matmul-heuristics is not installed (logged once as a warning), or when a query returns no usable configuration (logged once per runner at info level, and per shape at debug level).

The policy is process-wide, like the AutoTuner it configures, so engines that share a process should use the same config; target and draft engines share the LLM args and therefore the policy.

autotuner_nvmmh_config replaces the environment variables of the previous NVFP4-only pruning (TRTLLM_CUTEDSL_NVMMH_ENABLE, TRTLLM_CUTEDSL_NVMMH_FIELDS, TRTLLM_CUTEDSL_NVMMH_MAX_TACTICS), which this PR removes. There is no per-field selection: every field that nvMMH models is used.

How it works

  • nvMMH chooses, the runner realizes. Every field nvMMH models (CTA tile, cluster shape, split-K, rasterization order, swizzle) is used as returned. Only knobs nvMMH does not model are swept inside each configuration: prefetch, the persistent tile scheduler, and the preferred/fallback cluster launch.
  • Kernels describe what they can run. Each runner passes nvMMH a validity callback built on the kernel's can_implement, plus backend properties (in-place split-K, column-major rasterization, fallback clusters), so nvMMH ranks only configurations the kernel can run.
  • Both A/B orientations. The SM107 block-scaled runners query nvMMH for the plain and the A/B-swapped problem at every M and merge the two rankings by nvMMH's ranking score. The SM100 NVFP4 runner does the same where its M rule allows both orientations (128 < M < 256). With nvMMH off, the M rule is unchanged.
  • Cache identity. The new TunableRunner.tactic_space_key() (default None) appends ("nvmmh", <library version>, max_tactics) to the profiling-cache key, so entries tuned with and without guidance are never mixed. Wrapper runners pass it through: NVFP4GemmUnifiedRunner while its CuTe DSL backend is allowed, and LocalityDomainConcurrentTunableRunner from the runner it wraps.
  • Library versions. The adapter (tensorrt_llm/_torch/custom_ops/cutedsl_matmul_heuristics.py) supports both the nvidia-matmul-heuristics 0.1.0.x wheels and newer libheuristics builds. The two differ in which cluster shapes pair CTAs for 2-CTA MMA; an installation without version metadata is told apart by its API (newer builds have estimateSiliconMetricEx and setBackendPropertyValue), with a one-time warning. It also fixes the precision tokens: NVFP4 is OOTST, while the previous F4F4T parsed as TF32 × E0M3.
  • Rasterization order. nvMMH's CUTLASS3 cta_order 0 rasterizes along M and 1 along N, as in CUTLASS's own nvMMH provider for that target (heuristics_provider.py#L222). The previous NVFP4 pruning read cta_order only when TRTLLM_CUTEDSL_NVMMH_FIELDS included it, and then mapped 0 to rasterization along N.
Arch Runner Chosen by nvMMH Swept per configuration

¹ BMM: only while its output holds every row of A. ² Only while the output M is not bucketed below the input M. ³ Within the full sweep's M rule (swap A/B for M ≤ 128, no swap for M ≥ 256), so nvMMH ranks both orientations only for 128 < M < 256; the SM107 block-scaled runners rank both orientations at every M.

Kernel and runner changes

  • SM100 FP8 blockwise GEMM/BMM: N = 32/64 CTA tiles; a tile narrower than a 128-column scale block of B uses that block's scale. Adds split-K: each slice takes a balanced K-tile range and reduce-adds its partial into the zeroed output with TMA.
  • SM100 block-scaled (NVFP4) GEMM: split-K with balanced K-block ranges and a TMA reduce-add, for FP32, FP16 or BF16 output.
  • SM100 BF16 GEMM: uses the kernel's existing direct split-K.
  • SM100 full sweeps of these three GEMMs: add splits 2/4/8 for K ≥ 4096 and N ≤ 512 (BF16 GEMM and FP8 blockwise BMM: only while the output holds every row of A), the rule of the SM107 BF16 GEMM. One helper, _sm100_split_k_candidates, holds the rule for all three. All three sweeps split K only with the smallest cluster along M of each tile (the number of CTAs per MMA), and the NVFP4 sweep only with a single-column cluster and no prefetch. On GB300 the fastest NVFP4 and FP8 blockwise tactic of these subsets is within 0.1% of the fastest with split-K on every tactic, with 7–40% of the split-K tactics, and the BF16 sweep has 66 instead of 120 tactics (see Test Coverage).
  • SM107 FP8 blockwise GEMM/BMM: 256-row (B-reuse) tiles split the accumulator update over two warp groups, which removes an 816 B per-thread register spill. For example, BMM B=16 M=16384 N=1024 K=4096 drops from 4.7 ms to 370 µs. nvMMH may now choose these tiles.
  • SM107 block-scaled GEMM: split-K slices take balanced K-tile ranges, so any split up to the K-tile count runs.
  • SM107 block-scaled GEMM, nvMMH path: honors TRTLLM_CUTEDSL_DENSE_GEMM_SCHEDULER in the same way as the full sweep.

Fixes

  • SM100 BF16 GEMM/BMM tuning cache: now keyed on the bucketed output M. Before, every runtime M other than the tuning M missed the cache.
  • SM100 BF16 GEMM tuning cache: now keyed on the output dtype. Before, a tactic tuned for FP32 output was replayed for BF16 output, and vice versa.
  • SM100 BF16 → FP8 BMM: describes its FP8 output to nvMMH (TTQSQ).
  • SM100 FP8 blockwise and BF16 GEMM/BMM: now profiled with a cold L2, like the NVFP4, MoE and SM107 block-scaled runners.

Behavior changes with nvMMH off

These changes apply to every user of the affected runners, with or without autotuner_nvmmh_config:

  • SM100 FP8 blockwise GEMM/BMM and BF16 GEMM/BMM: profiled with a cold L2, which can change the tactic the AutoTuner picks.
  • SM100 FP8 blockwise full sweep: adds N = 32/64 tiles for M ≤ 256.
  • SM100 BF16 GEMM, NVFP4 GEMM and FP8 blockwise GEMM/BMM full sweeps: add split-K 2/4/8 for K ≥ 4096 and N ≤ 512, also with BF16 output (see Numerics). The CuTe DSL NVFP4 GEMM is one of the default nvfp4_gemm backends (nvfp4_gemm_config.allowed_backends defaults to cutlass, cublaslt, cutedsl, cuda_core), so on SM100/SM103 this applies to every NVFP4 Linear layer with K ≥ 4096 and N ≤ 512: the AutoTuner compiles and profiles 24 more CuTe DSL tactics per A/B orientation for it (8 tiles × 3 splits), and a split-K tactic runs wherever it profiles fastest of all backends. Measured on GB300 (see Test Coverage), the first autotuning of nvfp4_gemm in a process takes 125 s instead of 97 s for N = 512, K = 7168. Each tactic compiles once per process, whatever the K, so N = 256, K = 7168 and N = 512, K = 16384 autotuned next take 2.8 s instead of 2.3 s and 56.0 s instead of 55.7 s. The chosen GEMMs run 1.04–1.28× faster for M ≤ 256, where CuTe DSL split 8 is chosen at every M (mostly in place of cuBLASLt), and 1.01–1.20× at M = 1024; at M = 4096, where no split-K tactic is chosen, they stay within 3%. The FP8 blockwise CuTe DSL GEMM/BMM is opt-in; for the BF16 GEMM, see Numerics.
  • SM100 BF16 GEMM/BMM tuning cache: keyed on the output dtype (GEMM) and on the bucketed output M (see Fixes), so tuning-cache entries saved before this change are not reused.
  • SM107 block-scaled GEMM full sweep: any split-K factor up to the K-tile count runs, not only the factors that divide it.
  • SM107 FP8 blockwise GEMM/BMM: the 256-row accumulator-update rework also applies to the full sweep, which already includes the 256-row B-reuse tile.

Numerics

In-place split-K rounds each slice's partial to the output dtype and reduce-adds it into the zeroed output in arrival order. With BF16 output, a split of s therefore rounds up to 2s − 1 times instead of once, and for s > 2 the result is not bitwise reproducible across runs (two slices add commutatively into zero). With FP32 output, only the summation order changes.

  • SM100 BF16 GEMM: both the full sweep and nvMMH may split K with BF16 output, as for the SM107 BF16 GEMM. With nvMMH off, this changes the numerics of use_cute_dsl_bf16_gemm Linear layers (opt-in; enabled automatically with pipeline_parallel_size > 1 on SM100/SM103/SM107) that have BF16 output, K ≥ 4096 and N ≤ 512, whenever a split-K tactic profiles fastest. Measured on GB300 over 36 such shapes (see Test Coverage), the RMS error relative to the RMS of the result is 0.0017 without split-K (the same as cuBLAS) and 0.0025 / 0.0032 / 0.0040 with split 2 / 4 / 8.

  • SM100 NVFP4 GEMM and FP8 blockwise GEMM/BMM: both the full sweeps and nvMMH may split K with BF16 output, as for the BF16 GEMM. With nvMMH off, this changes the numerics of NVFP4 Linear layers (CuTe DSL is a default nvfp4_gemm backend) and of FP8 blockwise layers on the CuTe DSL backend (use_cute_dsl_blockscaling_mm / use_cute_dsl_blockscaling_bmm, opt-in) that have K ≥ 4096 and N ≤ 512, whenever a split-K tactic profiles fastest. Measured on GB300 (see Test Coverage), the RMS error relative to the RMS of the result is:

GEMM (shapes) Correctly rounded BF16 No split-K Split 2 Split 4 Split 8
    FP8 blockwise GEMM / BMM (24 / 6) 0.0017 0.0017 0.0024 0.0031 0.0040
    NVFP4 GEMM (24; median) 0.0017 0.0025 0.0032 0.0037 0.0045

The NVFP4 values are medians over the shapes; without split-K they range from 0.0019 to 0.0040, and the largest value with split 8 is 0.0055.

  • The full sweeps of the SM100 NVFP4 MoE FC2 GEMM (splits 2/4, BF16 atomics) and the SM107 block-scaled GEMM (splits 2/4/8) already split K with BF16 output on main.

  • The SM100 and SM107 NVFP4 epilogues multiply the BF16-rounded accumulator by a BF16-rounded alpha in BF16 (unchanged from main), so NVFP4 has a larger error than correctly rounded BF16 already without split-K, and each split-K slice is rounded twice before it is reduce-added. test_nvfp4_gemm_unified_all_tactics compares the autotuned nvfp4_gemm with the CUTLASS backend at rtol=1e-2, atol=0.15, which is about 0.002 of the output RMS at K = 4096; the split-K tactics differ from CUTLASS by up to 2–4 there (2 BF16 ulps), so [mnk15] (M = 1024, N = 128, K = 4096) failed whenever the AutoTuner picked one. Where the CuTe DSL backend can split K (SM100/SM103 with K ≥ 4096 and N ≤ 512, every shape on SM107), the test now uses atol = 0.05 × the RMS of the reference. On GB300, every CuTe DSL tactic of 11 such shapes (M 1–4096, N 128–512, K 4096–16384) stays within atol = 0.027 × the RMS, while a dropped or repeated K slice of a split of 8 would be off by about 0.35 × the RMS.

Dependency

requirements.txt still pins nvidia-matmul-heuristics==0.1.0.27. The GPU tests below pass with both 0.1.0.27 and a newer libheuristics build with the Rubin CUTLASS3 model fixes, which are being upstreamed separately, so both API generations are covered. The benchmarks use this newer build. On GB300, 0.1.0.27 returns the same nvMMH-guided tactics as this build for 22 of the 24 CuTe DSL GEMM/BMM shapes of the DeepSeek V4.1 Flash benchmark.

The warm-cache replay reruns pair 3 with each arm's autotuner cache from its cold run, so both arms use the same tactics as before without profiling; it shows the run-to-run spread.

Across the 48 CuTe DSL GEMM/BMM shapes of this workload (8 FP8 BMMs and 40 MXFP8 GEMMs), the AutoTuner-profiled time of the tactic picked under nvMMH differs from that of the full-sweep pick by -0.56% on geomean (pair 1). The per-shape range is +5.1% (M=8 N=6144 K=7168, where nvMMH rasterizes along M and the full-sweep winner along N) to -9.3% (M=32 N=2048 K=7168). 30 of the 48 nvMMH picks are configurations that the full sweep does not enumerate, such as split-K 3/7/11/13 or a (4, 1) cluster.

DeepSeek V4.1 Flash, generation-only (GB300)

  • DeepSeek V4.1 Flash, generation-only, with the serving configuration above: MTP disabled; 2 nodes x 4 GPUs; TP8 / EP8 / ADP8; local maximum batch size 32; concurrency 256; 2,560 requests; ISL/OSL 1,024 / 1,024
  • GPUs: GB300 (SM103). V4.1 runs on GB300 because the CSA2 MXFP8 projections on main require SM100/SM103
  • V4.1 options: sparse_attention_config: {algorithm: csa2}, custom_tokenizer: deepseek_v41, disable_mm_encoder: true (text only)
  • CuTe DSL GEMMs of this workload: 8 FP8 blockwise BMMs and 16 FP8 blockwise GEMMs (SM100 runners). The other tuned ops (MXFP8 projection GEMM, MoE, mHC) are not nvMMH-guided and keep their full tactic lists in both arms
  • Same container, native libraries, libheuristics build, nvMMH settings and cache isolation as above. These runs predate the split-K commit (see Test Coverage), so the full-sweep arm has no FP8 blockwise split-K tactics

Values are the mean of three cold full-sweep/nvMMH pairs. Each pair ran in its own 2-node allocation; pairs 1 and 2 ran the full sweep first and pair 3 ran nvMMH first.

With a warm cache, where nothing is profiled, the first pass still takes 5.0–9.3 s. The autotuner phase also runs a second 128-token warmup shape that takes 122–145 s in every arm, warm or cold, so it does not depend on the cache or on nvMMH.

The cold-pair means include bursts of slow decode steps that are not caused by the nvMMH tactics; see Why the cold pairs differ and nvMMH GEMM picks alone below.

The warm-cache replay reruns pair 3 with each arm's autotuner cache from its cold run, so both arms use the same tactics as before without profiling; it shows the run-to-run spread.

nvMMH GEMM picks alone

To isolate the CuTe DSL GEMM picks, pair 3's full-sweep cache was replayed against a copy in which only the 192 CuTe DSL GEMM/BMM entries (24 shapes × 8 ranks) carry the nvMMH run's picks; every other op keeps its full-sweep pick. Both caches ran twice in one allocation, in ABBA order, with autotuner_nvmmh_config: null.

Arm Output throughput Mean TPOT Median step Steps > 45 ms

A: full-sweep cache 8,316 tok/s 30.321 ms 29.89 ms 121
B vs A +0.51% -0.54% +0.02%
Why the cold pairs differ

The cold pairs disagree with the warm-cache replay, which reruns both cold caches of pair 3 in one allocation and gives +0.15% for nvMMH. The rank-0 iteration log (the host_step_time of every decode step) shows where the gap comes from. Decode steps normally take about 29.8 ms in every arm, but in many runs a burst of slow steps (over 45 ms, often twice the normal time) appears two to three minutes into the benchmark. It hit all three nvMMH cold arms (86, 181, 332 slow steps; full-sweep cold arms: 12, 25, 116), but it also appears in every warm replay, with the full-sweep cache (123, 132, 121 slow steps) as well as with the nvMMH cache (141), so it is not a property of the nvMMH tactics.

Pair Median step (full / nvMMH) Mean step Mean step without steps > 45 ms Steps > 45 ms

CuTe DSL GEMM picks

Across the 24 CuTe DSL GEMM/BMM shapes, nvMMH leaves 1–4 tactics per shape instead of 5 because, for these small-M FP8 problems, it returns only 3–10 configurations that the kernels implement, several of which differ only in fields the kernels do not expose (e.g. the warp tile). 16 of the 24 shapes pick the same tactic in both arms (pair 1). Timing both picks of the other 8 shapes back to back in one process with the AutoTuner's profiler (cold L2, median of 5 alternating rounds), the nvMMH pick is at most +1.0% (0.1 µs) slower for M ≤ 64 and +1.8% to +2.6% (up to 0.2 µs) at M = 128. In this benchmark each rank decodes at most 32 tokens per step, so only the M ≤ 32 buckets are used. Every nvMMH pick is also in the full sweep's tactic list.

GEMM level (development measurements)

  • VR200, 29 DeepSeek-V3/R1/V4 reference GEMM/BMM shapes: every nvMMH-guided best tactic is within 3% of the best full-sweep tactic (max +1.6%), with 504 instead of 31,382 tactics profiled (an earlier build of the newer libheuristics).
  • GB300, same shapes, with the released nvidia-matmul-heuristics 0.1.0.27: 25/29 within 3%, with 1,950 → 127 tactics profiled. The misses come from 0.1.0.27's cluster choices.

Test Coverage

New or updated GPU tests:

  • tests/unittest/_torch/misc/test_autotuner.py::test_nvmmh_tactics_compute_the_product (new; SM100/SM103 and SM107): every nvMMH-guided tactic of the BF16 GEMM (BF16 / FP32 output), BF16 BMM (BF16 output; FP8 output on SM100/SM103), FP8 blockwise GEMM / BMM, NVFP4 GEMM and, on SM107, MXFP8 GEMM runners comes from nvMMH and matches a reference, including tiles, rasters and split-K factors outside the full sweeps.
  • tests/unittest/_torch/misc/test_autotuner.py::test_cutedsl_nvfp4_heuristic_matches_full_sweep (updated): enables nvMMH through AutoTuner.nvmmh_config instead of the removed environment variables.
  • tests/unittest/_torch/kernels/parallel/test_cute_dsl_bf16_dense.py::test_cute_dsl_bf16_split_k_gemm_blackwell (new; SM100/SM103): BF16 GEMM split-K 2/4/8 with BF16 and FP32 output, checked element by element against an FP32 reference, after a NaN-poisoned relaunch and in a CUDA-graph replay. It also checks that the full sweep offers each split for both output dtypes. The file was test_cute_dsl_bf16_dense_rubin.py; it is renamed because it now also holds an SM100/SM103 test.
  • tests/unittest/_torch/kernels/parallel/test_fp4_linear.py::test_nvfp4_gemm_cutedsl_split_k (new; SM100/SM103): the NVFP4 full sweep offers split-K 2/4/8 for N = 512, K = 7168 with and without swapping A and B, and each split matches the CUTLASS NVFP4 GEMM, also in a CUDA-graph replay into a NaN-filled output.
  • tests/unittest/_torch/kernels/parallel/test_fp4_linear.py::test_nvfp4_gemm_unified_all_tactics (updated): atol = 0.05 × the RMS of the reference where the CuTe DSL backend can split K (see Numerics).
  • tests/unittest/_torch/kernels/parallel/test_fp8_block_scale_gemm.py::test_cute_dsl_fp8_block_scale_gemm_split_k and ::test_cute_dsl_fp8_block_scale_bmm_split_k (new; SM100/SM103): the FP8 blockwise GEMM and BMM full sweeps offer split-K 2/4/8 for N = 512, K = 7168, with a different scale magnitude per 128-column K block so that a slice using another slice's scales fails, and each split matches an FP32 reference, also in a CUDA-graph replay into a NaN-filled output. The BMM offers no split-K when its output has more rows than A.
  • tests/unittest/_torch/kernels/parallel/test_fp8_block_scale_gemm.py::test_cute_dsl_fp8_block_scale_gemm_tile_shapes and ::test_cute_dsl_fp8_block_scale_bmm_tile_shapes (new; SM100/SM103): every MMA tile of the FP8 blockwise GEMM and BMM full sweeps, with and without a cluster along N, matches an FP64 reference of the dequantized operands, including the N = 32/64 tiles that use the scale of the 128-wide B scale block they fall in. The magnitude of B differs between its scale blocks along N, so a tile that used the scale of another block fails.
  • tests/unittest/_torch/kernels/parallel/test_fp8_block_scale_gemm.py::test_cute_dsl_fp8_bmm_quantize_rubin_nvmmh_tactics (new; SM107): every nvMMH-guided tactic of the FP8 BMM with fused 1x128 quantization matches the BF16 BMM of the same tactic quantized separately.
  • tests/unittest/_torch/kernels/parallel/test_fp8_block_scale_gemm.py::test_cute_dsl_fp8_block_scale_bmm_rubin_tile_shapes (new; SM107): every MMA tile of the SM107 FP8 blockwise BMM, including the 256-row tiles whose accumulator update is split over two warp groups.
  • tests/unittest/_torch/misc/test_autotuner.py (new; no GPU kernels): tactic_space_key() extends the profiling cache key, survives a cache save and load, and follows the nvMMH policy; NVFP4GemmUnifiedRunner keys only its CuTe DSL tactic space, and LocalityDomainConcurrentTunableRunner forwards the key; the engine installs its nvMMH policy; rankings merge by score; select_tactics counts the configurations that add new tactics; and AutoTunerNvMMHConfig rejects non-positive or non-integer max_tactics.
  • tests/unittest/api_stability/references/llm.yaml: autotuner_nvmmh_config
  • Regenerated tensorrt_llm/schemas/trtllm-serve{,-disagg}-config.schema.json and tensorrt_llm/usage/llm_args_golden_manifest.json
  • CI test lists: B200 and GB300 run unittest/_torch/kernels/parallel pre-merge, which holds the new and updated kernel tests, and now also test_autotuner.py::test_nvmmh_tactics_compute_the_product. The rest of test_autotuner.py runs pre-merge on H100 through unittest/_torch/misc. GR100 has only a post-merge stage; l0_gr100.yml now lists test_cute_dsl_bf16_dense.py, test_fp4_linear.py::test_nvfp4_gemm_cutedsl, the five SM107 CuTe DSL tests of test_fp8_block_scale_gemm.py (test_cute_dsl_fp8_block_scale_gemm_rubin, test_cute_dsl_fp8_block_scale_bmm_rubin, test_cute_dsl_fp8_block_scale_bmm_rubin_tile_shapes, test_cute_dsl_fp8_bmm_quantize_rubin_matches_separate, test_cute_dsl_fp8_bmm_quantize_rubin_nvmmh_tactics) and test_nvmmh_tactics_compute_the_product. The SM107 cases of the other tests that exercise these runners (test_fp8_linear.py, test_mxfp8_mxfp8_gemm.py, test_cute_dsl_bf16_bmm_fp8out.py, test_cute_dsl_quant_dense_rubin.py, test_cute_dsl_bf16_dense_locality_domain_rubin.py, the MXFP8 and CUDA-graph tests of test_fp8_block_scale_gemm.py, and test_nvfp4_gemm_unified_all_tactics) have no GR100 entry, as on main, so on SM107 they stay QA and local tests; the Blackwell stages that run unittest/_torch/kernels/parallel skip them.

Results on commit c4d08f9afc (main a8283516d8) unless an item names another commit. The PR has three commits on main e3e0b12d2b: 0a39cdc877 rebases c4d08f9afc and adds the wrapper runners' tactic_space_key() pass-through; b8c22140f0 adds split-K to the SM100 full sweeps (see Behavior changes with nvMMH off); and the head 5e0622b44d restricts the BF16 full-sweep split-K to the smallest cluster along M, logs nvMMH fallbacks, rejects SM100 block-scaled split-K for other output dtypes, and adds the tests, CI test-list entries and test_nvfp4_gemm_unified_all_tactics tolerance above. Before the rebase onto e3e0b12d2b they were 234b7645a3, 1bc5244f32 and 73b197eb5f on main 18c972e22c, the commits the items below name. The rebase keeps both sides' changes in the conflicts in l0_gr100.yml and tensorrt_llm/llmapi/__init__.py and changes no code apart from formatting _configure_autotuner_nvmmh() in model_engine.py with ruff, which main now uses for that file.

The GPU tests and the generators' --check have not been rerun since the rebase: they need native libraries built from the new main
  • BF16-output split-K in the SM100 BF16 GEMM full sweep, GB300 (SM103), nvMMH off:
    • 36 shapes with BF16 output (N 64–512, K 4096–16384, M 1–4096), measured with split-K on every cluster (120 tactics per shape, 30 without split-K): each tactic matches an FP64 reference
    • timed as the AutoTuner times them (cold L2, CUDA graph), a split-K tactic is fastest for 32 of the 36 shapes: 1.4–2.0× faster than the fastest unsplit tactic for M ≤ 256 (2.8–3.0× at K = 16384), 1.02–1.9× at M = 1024 and at most 1.07× at M = 4096
    • with split 4 or 8, 36–97% of the output elements change between repeated launches for M ≤ 1024; split 1 and 2 are bitwise reproducible
    • cost with split-K on every cluster: JIT-compiling all 120 tactics takes 64 s, once per process and output dtype (about 0.5 s per added tactic); profiling them takes about 0.2 s per shape instead of 0.05 s
    • splitting K only with the smallest cluster along M (the head commit) leaves 66 tactics per shape (30 without split-K). JIT-compiling the tactics of the first shape takes 35 s instead of 64 s, and profiling the split-K tactics 0.06 s instead of 0.14 s per shape (medians). The unrestricted sweep picked a cluster of 4 along M for 7 of the 36 shapes; timed against that pick in 7 alternating rounds, the fastest restricted tactic is within 0.1% for 4 shapes, about 2% faster for 2 and 3.9% slower for N = 64, K = 7168, M = 256, where the same tactic measured 5.13 µs during the restricted sweep, below the 5.24 µs of the unrestricted pick
  • Split-K in the SM100 NVFP4 GEMM and FP8 blockwise GEMM/BMM full sweeps, GB300 (SM103), nvMMH off. The correctness, timing and numerics items were measured with split-K 2/4/8 on every tactic of these sweeps, a superset of the tactics they now split:
    • every full-sweep tactic matches an FP64 reference of the dequantized operands, for 24 NVFP4 GEMM shapes (N 256 / 512, K 4096–16384, M 1–4096; 240–480 tactics per shape, a quarter without split-K), 24 FP8 blockwise GEMM shapes (360 tactics for M ≤ 256 and 120 above, a quarter without split-K) and 6 FP8 blockwise BMM shapes (8 groups)

    • timed as the AutoTuner times them, a split-K tactic is fastest for 17 of the 24 NVFP4 shapes (1.02–1.05× faster than the fastest unsplit tactic at K = 4096, 1.13–1.31× at K = 7168, 1.29–1.94× at K = 16384), 21 of the 24 FP8 GEMM shapes (1.02–2.58×) and 5 of the 6 FP8 BMM shapes (1.05–1.68×); at M = 4096 it is at most 1.02× faster

    • with split 4 or 8, 28–93% (NVFP4) and 50–99% (FP8) of the output elements change between repeated launches for M ≤ 1024; split 1 and 2 are bitwise reproducible

    • splitting K only with the smallest cluster (NVFP4: also a single-column cluster and no prefetch) adds 24 instead of 180–360 NVFP4 tactics per A/B orientation, 36–108 instead of 90–270 FP8 GEMM tactics and 108 instead of 270 FP8 BMM tactics per shape. It keeps the fastest tactic of all 24 FP8 GEMM and 6 FP8 BMM shapes, and of 21 of the 24 NVFP4 shapes, where it is at most 0.07% slower. With these restricted sets, every FP8 blockwise GEMM (24 shapes) and BMM (6 shapes) tactic again matches an FP64 reference

    • cost: JIT-compiling a split-K tactic takes about 0.56 s (NVFP4) and 0.74 s (FP8), once per process whatever the K

    • the default nvfp4_gemm (all four backends), autotuned over all M buckets, then each M replayed 20 times in a CUDA graph, before and after this change on the same GPU (µs per GEMM, warm L2, median of 7 replays; after: CuTe DSL split 8 for M ≤ 256 and split 4 at M = 1024 for N = 256, K = 7168 and N = 512, K = 16384; no split-K at M = 4096):

With split-K on every tactic (a separate run on another GB300), the first autotuning took 379 s, 6.9 s and 222 s, the speedups were 1.05–1.27× for M ≤ 256, and 12 of the 18 picks were the same; the other 6 differ in the cluster or the tile.

Dev Engineer Review

The change adds optional nvMatmulHeuristics (nvMMH) guidance for CuTe DSL GEMM/BMM autotuning. When configured, runners select tactics expanded from up to max_tactics ranked configurations. When guidance is unset, unavailable, or returns no usable configurations, runners fall back to full tactic enumeration. Tactic-space cache keys separate tuning results for different policies.

The change adds split-K, swizzle, and raster-order options to Blackwell and Rubin kernels. Some split-K paths use reduction stores and require the output to be zeroed before launch. SM100 block-scaled split-K restricts output types and cannot combine with indexer-Q fusion. Verify these paths across supported shapes and hardware. The PR reports possible BF16 split-K non-reproducibility and increased rounding error.

The new configuration is exposed through Python APIs and serving schemas. The previous NVFP4-specific environment controls are removed. Verify downstream compatibility and consistency between schema constraints and runtime validation.

The PR reports autotuning-time reductions and mixed serving-throughput results. Test execution, benchmark results, and completion status are not independently verified. The PR description reports two LLM-argument test failures that require a local Qwen3-0.6B checkpoint. Review severity counts are unavailable because no current review findings were supplied.

QA Engineer Review

Changed tests cover nvMMH tactic selection, cache identity, configuration wiring and validation; Blackwell split-K correctness; FP8 block-scaled GEMM/BMM split-K, tile shapes and fused quantization; and NVFP4 split-K. The changed autotuner test test_nvmmh_tactics_compute_the_product is listed in l0_b200.yml, l0_gb300.yml, and l0_gr100.yml. The changed BF16 test file and selected FP4 and FP8 tests are listed in l0_gr100.yml. The FP4 test file is listed in l0_gb10.yml. The available search found no manual-QA entries. Coverage verdict: needs follow-up because several changed tests are not individually listed in the inspected CI lists, and test execution results are unverified.

587-590: Trivial · Data Integrity & Integration · Quick win

Add a regression test for the tactic_space_key() cache-key discriminator.

get_cache_key now appends runner.tactic_space_key() when the value is not None. This keeps profiling-cache entries tuned with nvMMH guidance separate from entries tuned without it. The changed tests do not check that separation. They also do not check that the extended key survives save_cache and load_cache, which use str(key) and ast.literal_eval.

These regressions would go unnoticed:

  • A runner key that drops the discriminator. Entries tuned under one policy would then be reused under the other.
  • A non-literal discriminator. _deserialize_cache_data would then skip it, and the op would re-profile on every load.

Add a small test in tests/unittest/_torch/misc/test_autotuner.py. Use a stub TunableRunner whose tactic_space_key() returns ("nvmmh", "x", 3) or None, depending on a flag. The test should check three things:

  1. The two keys differ, and the None key equals the old four-element tuple.
  2. A search_cache lookup under one policy misses the entry stored under the other policy.
  3. A save_cache then load_cache round trip in tmp_path keeps the extended key.

The test needs no GPU kernel. Register it in l0_cpu.yml if AutoTunerProfilingCache can be constructed without a GPU. Otherwise, confirm which GPU test list should carry it.

As per path instructions: "For each new or materially changed observable behavior, determine whether this PR adds, updates, or clearly identifies an existing test that meaningfully exercises the change."

The nvMMH-guided path is well isolated behind autotuner_nvmmh_config, but a fair amount of this PR changes behaviour with nvMMH off, and the description reads as if only the opt-in path is affected. Please list these explicitly (or split them out):

  • use_cold_l2_cache=True is newly enabled on the SM100 FP8 GEMM/BMM and BF16 GEMM/BMM runners. That changes which tactic wins for every user, not just nvMMH users.
  • The SM100 FP8 blockwise full sweep now includes N=32/64 tiles for M≤256 (_sm100_fp8_blockwise_mma_tiler_candidates), backed by new kernel code (sfb_tile_granularity_n, tmem atom repetition).
  • The SM100 BF16 GEMM full sweep gains split-K candidates for FP32 output, and its unique_id now includes output_dtype (invalidates existing cache entries).
  • New constraint_specs on the BF16 GEMM/BMM tuning configs.
  • Rubin dense block-scaled split-K relaxed from "K tiles divisible by split_k" to balanced ranges.
  • kernels/rubin/blockwise_gemm/blockwise_gemm.py (+738/−384) is mostly an independent rework of the 256-row accumulator update (split over two warp groups, new named barriers 4–6, register re-split, num_acc_stage change). This is a kernel optimization in its own right and would be much easier to review and bisect as its own PR.

CI coverage on SM107. l0_gr100.yml does not reference unittest/_torch/kernels/parallel or test_autotuner.py, so none of the new SM107 tests (BF16 dense, FP8 BMM tile shapes, test_nvmmh_tactics_compute_the_product) and none of the Rubin kernel changes run in CI. Please either add them to an SM107 list or state that they are QA/local-only for now. SM100/SM103 coverage is fine via l0_b200.yml/l0_b300.yml parent directories.

Numerics policy for split-K (see inline). The full sweeps gate in-place split-K on FP32 output because the TMA reduce-add rounds partials to the output dtype; the nvMMH path does not apply that gate for BF16-output GEMMs (BF16, FP8, NVFP4). That should be a deliberate, documented decision rather than an accident of which path is taken.

Smaller points:

  • max_tactics counts nvMMH configurations; on SM107 each expands across prefetch × scheduler × mixed-cluster, so 5 can mean 20–40 profiled tactics. Worth saying in the field description.
  • The pure-Python parts (tactic_space_key in the cache key, wrapper passthrough, _merge_nvmmh_rankings, select_tactics, NvMMHConfig validation) have no CPU tests even though they need neither GPU nor nvMMH.

JIRA tag, docs §4.5, golden manifest, schemas and API reference are all updated. The new LLM-arg field still needs the telemetry/privacy CODEOWNER sign-off per AGENTS.md.

The full sweeps of the SM100 BF16 GEMM, NVFP4 GEMM and FP8 blockwise
GEMM/BMM offer in-place split-K 2/4/8 for K >= 4096 and N <= 512, also
with BF16 output, as nvMMH and the SM107 BF16 GEMM already do. The BF16
GEMM and the FP8 blockwise BMM split only while the output holds every
row of A. The NVFP4 and FP8 blockwise sweeps split K only with the
smallest cluster along M of each tile, and NVFP4 only with a
single-column cluster and no prefetch.

…t-K and extend the CuTe DSL GEMM tests

Tactics and checks:
- The full sweep of the SM100 BF16 GEMM offers split-K only with the
smallest cluster along M of each tile, like the FP8 blockwise GEMM/BMM
sweeps. This cuts the sweep from 120 to 66 tactics for split-K shapes.
- Log the shapes nvMMH returns no tactic for, which run the full sweep:
once per runner at info level, each shape at debug level.
- Warn once when autotuner_nvmmh_config is set but nvMatmulHeuristics
  cannot be imported.
- Treat an nvMMH installation without version metadata as a 0.1.0.x
release only if it lacks the per-backend silicon-metric API.
- Reject split_k > 1 in the SM100 block-scaled GEMM unless the output is
  FP32, FP16 or BF16.
- Describe max_tactics as a count of kernel configurations, and
  regenerate the serving schemas.

Tests:
- Pure-Python AutoTuner tests: tactic_space_key() extends the profiling
cache key, survives a cache save and load, and follows the nvMMH
policy; NVFP4GemmUnifiedRunner keys only its CuTe DSL tactic space and
LocalityDomainConcurrentTunableRunner forwards the key; the engine
installs its nvMMH policy; rankings merge by score; select_tactics
counts configs that add new tactics; and AutoTunerNvMMHConfig rejects
  non-positive or non-integer max_tactics.
- The SM100 FP8 blockwise GEMM and BMM run every MMA tile of their full
sweeps, including the N = 32/64 tiles inside a 128-row scale block of
B, against a dequantized reference whose B scale blocks differ in
  magnitude along N.
- Every nvMMH-guided tactic of the SM107 FP8 BMM with fused 1x128
quantization matches the BF16 BMM of the same tactic quantized
  separately.
- CuTe DSL split-K tactics round each K slice's partial sum to BF16
before reducing it into the output. Where the CuTe DSL backend can
  split K (SM100/SM103 with K >= 4096 and N <= 512, every shape on
  SM107), test_nvfp4_gemm_unified_all_tactics compares with atol = 0.05
x the RMS of the reference instead of 0.15.
- Run test_nvmmh_tactics_compute_the_product pre-merge on B200 and
GB300, and list the SM107 CuTe DSL GEMM/BMM tests in l0_gr100.

Test the new serving schema values.

tests/unittest/llmapi/test_trtllm_serve_config_schemas.py does not cover autotuner_nvmmh_config. A regression could make the editor schemas accept invalid limits or reject valid ones. Add cases for a positive limit, zero, and an unknown nested field in both serve and disaggregated configurations. (raw.githubusercontent.com)

As per coding guidelines, serving-field changes must “add regression coverage for the affected accepted/rejected values.”
