Dev Engineer Review

The change adds opt-in deterministic paths for BF16 attention, linear and router operations, MoE, NCCL reductions, and GDN/Mamba2 recurrence. Fixed reduction order and FP32 accumulation aim to reduce token-count-dependent arithmetic differences. Hardware, dtype, shape, and operation limits preserve existing fallback paths, including the locality-domain path for Rubin-sharded weights.

The deterministic MoE path also changes finalization and tuning policy for specified BF16 SM100/SM103 workloads. QA should check eligibility boundaries, fallback behavior, and performance impact. The supplied information reports scoring results and test coverage, but no test execution results. Current review finding counts are unavailable.

QA Engineer Review

New tests cover attention, linear and gating, MoE, distributed reductions, Mamba/GDN recurrence, and prefill/decode scoring. Test-list changes add entries to l0_b200.yml, l0_cpu.yml, and l0_gb200_multi_gpus.yml.

The supplied test summaries cover token-count and phase invariance, mixed batches, cache boundaries, reference comparisons, error paths, and CUDA graph replay. Coverage verdict: needs follow-up. The supplied summaries do not show CI or manual-QA list entries for most new test files. Test execution status and manual-QA list changes are unavailable.

Description

Scoring the same token continuation through prefill and decode can produce different logprobs even with FORCE_DETERMINISTIC=1. GEMM, attention, hybrid recurrence, and tensor-parallel reductions can change their arithmetic with token count.

Align the supported BF16 paths using fixed linear/router reductions, deterministic dense causal attention, shared FP32 GDN/Mamba2 recurrence, fixed BF16 CUTLASS expert tactics and finalize policy, and fixed-order FP32 NCCL rank reduction with matching RMS/residual-RMS epilogues. Include the finalize policy in the MoE runner cache, propagate deterministic mode to MPI workers, and bound context-attention metadata to the prefill requests in mixed batches.

Add operator and tiny-model regressions plus a frozen-token scoring example. DeepSeek-V4 sparse MLA and MXFP4/MXFP8 expert work is a separate dependent change.

This work came out of prefill/decode consistency testing. No associated NVBug is recorded. Related to #19501.

Dependencies and Scope

Builds on #20226 (GDN mixed-batch decode), whose helpers this change reuses, and on #19859 and #19860; all three are already in main. It does not require fix/mhc-deterministic-dispatch (#20228) or fix/moe-deterministic-finalize (#20227).

Deterministic BF16 linear and router paths apply to local weights only. Rubin locality-domain sharded Linear/DeepseekV3Gate weights keep the locality-domain path. The FlashInfer TRTLLM-Gen library stays available for environment checks (is_environment_available) and opts out only in per-layer selection (_is_available) when deterministic attention is requested, so the deterministic FMHA library or the fallback is selected instead.

Test Coverage

Recorded frozen-token validation used three prompt/response sequences and 381 actual decode scores per model, with separate initial-boundary checks. Eager and chunk128 plus CUDA Graph runs repeated exactly in the tested configurations:

  • Qwen3.6-27B BF16 TP1: maximum absolute logprob difference 1.899384 -> 0.
  • Qwen3.5-35B-A3B BF16 TP1: 0.491834 -> 0.
  • Nemotron-H Nano BF16 TP1: 0.267308 -> 0.
  • Nemotron-H Ultra BF16 TP8 on two GB200 nodes: 0.227920 -> 0.

Recorded component coverage includes reference comparisons, indexed pools, mixed batches, padding, expert tactics, TP linear, updated-input CUDA Graph replay, 18 collective dtype/fusion/bias combinations, 19 CPU probe cases, and six tiny-model integration cases.

Walkthrough

This pull request adds deterministic PyTorch paths for attention, selected arithmetic operations, and recurrent models. It also adds a command-line probe that compares generation-token logprobs with prefill scores for the same frozen token sequence.

Changes

Deterministic PyTorch execution

Layer / File(s) Summary
Deterministic FMHA selection and execution
docs/source/features/attention.md, tensorrt_llm/_torch/attention/backends/fmha/*, tensorrt_llm/_torch/attention/kernels/deterministic_attention.py, tests/unittest/_torch/attention/*
The FMHA registry adds a deterministic backend with documented BF16, hardware, and attention-shape limits. The backend dispatches causal paged attention to a Triton kernel. Tests cover supported configurations, attention output consistency, and backend selection.
Fixed-reduction linear, MoE, and NCCL paths
docs/source/features/attention.md, tensorrt_llm/_torch/modules/deterministic_linear.py, tensorrt_llm/_torch/modules/linear.py, tensorrt_llm/_torch/models/modeling_*.py, tensorrt_llm/_torch/custom_ops/torch_custom_ops.py, tensorrt_llm/_torch/distributed/*, tests/unittest/_torch/*, tests/integration/test_lists/test-db/*
FORCE_DETERMINISTIC=1 selects fixed-reduction paths for supported BF16 linear and gate projections, selected MoE execution, and specified NCCL all-reduces. Tests check numerical references, consistency across batch sizes, CUDA graph behavior, and MoE runner caching.
Deterministic GDN and Mamba2 recurrence
docs/source/features/attention.md, tensorrt_llm/_torch/modules/mamba/*, tests/unittest/_torch/modules/mamba/*
Under the documented conditions, GDN and Mamba2 use recurrent execution with FP32 state arithmetic. Tests compare full-prefill and split prefill/decode results and check recurrent and convolution state updates.

Prefill/decode consistency probe

Layer / File(s) Summary
Probe execution, reporting, and validation
examples/llm-api/llm_prefill_decode_consistency.py, examples/llm-api/README.md, tests/unittest/llmapi/*prefill_decode*, tests/integration/test_lists/test-db/*
The probe compares generation logprobs with prefill scores for the same token sequence, writes incremental JSON results, and supports an optional decode-delta threshold. CPU and GPU tests cover validation, scoring, prefill/decode consistency, and cache-related cases.

Merge Risk: Minimal · up to 740f9

This change adds deterministic prefill and decode arithmetic paths and a consistency probe. No concrete merge-blocking defect was found. The remaining feedback is limited to making two tests more precise: removing an unused tensor-parallel parameter and exercising the MoE finalize override through the op default.

Explanation

The description follows the template's main sections. It has a Description section that explains the problem (prefill and decode logprob differences in deterministic mode) and the fix (fixed-order BF16 linear, router, attention, GDN/Mamba2, MoE, and NCCL paths). It has a Test Coverage section with specific results: four BF16 models, 381 decode scores per model, 18 collective combinations, 19 CPU probe cases, and six tiny-model cases. It also has a Dependencies and Scope section that states related PRs and the locality-domain exclusion. The PR Checklist is present, and the final box is checked. The title is not in the description body, so the template's title format cannot be verified from the description. The description does not give the exact test file names in the Test Coverage section, which would help reviewers map each claim to a test.

Explanation

The title clearly summarizes the main change: aligning BF16 prefill and decode arithmetic in deterministic mode. The review-status prefix adds minor noise but does not make the title unclear or misleading.

Remove the unused tp_size parametrization.

The deterministic path passes only tensors to deterministic_linear. This test does not shard weights or perform a tensor-parallel reduction, so both tp_size values run the same computation and do not provide TP coverage.

PR effort13 points — Attention-side work spans dense attention, GDN and Mamba2 kernels or dispatch. Exact phase equivalence requires deep reasoning about FP32 arithmetic, causal bounds, paged indexing, mixed batches, recurrent state and fallback behavior, supporting 13 points independently of broader MoE and collective changes.
ImportanceImportant — Introduces a per-query paged attention kernel and changes FMHA selection under deterministic flags. GDN and Mamba2 also change prefill/decode recurrence paths, creating sensitive numerical, state-continuity and performance contracts.

Four of the new GPU test files are not in any test list, so CI never runs the kernels this PR is built on: tests/unittest/_torch/attention/kernels/test_deterministic_attention.py, tests/unittest/_torch/attention/test_deterministic_fmha.py, tests/unittest/_torch/modules/mamba/test_deterministic_ssm.py, and tests/unittest/_torch/modules/mamba/test_gdn_phase_consistency.py (the additions to test_flashinfer_trtllm_gen_fmha.py land in an unregistered file too). Please add them to l0_b200.yml (or wherever SM100/103 coverage lives) alongside the entries you already added.

Scope and tracking. This touches attention, GEMM, MoE, collectives, GDN and Mamba2, plus a diagnostic tool, under a [None][fix] tag and a CodeRabbit-generated description. It is a feature (new FMHA library, four Triton kernels, a new env var, a probe script), so it needs a JIRA and an author-written description or short design note stating the invariant being guaranteed and its preconditions. Per AGENTS.md "one concern per PR", at least the MoERunner.runner_dict key fix for use_fused_finalize (torch_custom_ops.py:152) is an independent correctness fix that should land on its own; splitting the remaining subsystems would also make each reviewable by its code owners.

Semantics of an existing flag. FORCE_DETERMINISTIC=1 already has consumers (prefix-reuse off in py_executor_creator.py, allreduce_helper.py, GDN split-decode). After this PR the same flag also routes every unquantized BF16 Linear on every architecture to an unautotuned Triton GEMM (the gate in linear.py:622 has no SM check, unlike the MoE and attention gates), replaces NCCL allreduce with an allgather that holds tp_size input copies, and runs prefill through serial recurrences. Existing users of the flag will see a large throughput and memory change. Either gate the new behavior behind the SM100/103 condition the rest of the bundle uses, or call out the change prominently in release notes and the docs section.

Guarantee coherence. The property only holds under a specific bundle: NCCL strategy, TRTLLM attention backend, FP32 SSM cache, SM100/103, supported head dims and page sizes. Outside it the user pays the GEMM/attention cost with no guarantee and no signal. A one-time startup warning when the flag is set but a precondition is unmet (attention library not selected, non-NCCL strategy, BF16 SSM cache) would make the mode safe to recommend.

Docs: the new env var and the mode are documented in attention.md; add a release-note entry for the flag's broadened meaning.

This allocates a [tp_size, numel] copy of the input from the allocator on every allreduce call. For a 16k-token prefill with hidden 8192 in BF16 at TP=8 that is roughly 2 GB per call, on top of the activation itself, and it happens for every TP allreduce in the model. Consider a persistent workspace sized at max_num_tokens * hidden * tp_size (reused across calls, graph-capture safe) or chunking the gather over rows so peak memory stays bounded. At minimum, document the peak in the attention.md section so users size free_gpu_memory_fraction accordingly.

When any of these conditions fails (page size 16, attention sinks, sliding window, heads ratio > 32, FP8 KV cache, spec decoding), selection falls through to FallbackFmha and the model silently runs the non-deterministic C++ kernels while the user believes the mode is active. Add a logger.warning_once here (and in _is_available) naming the failing condition, so a misconfigured deployment is visible in the log instead of only in the logprob drift.

Two issues with this gate. (1) It has no SM condition, so the flag now swaps the GEMM on every architecture, unlike the MoE (get_sm_version() in (100, 103)) and attention gates. If that is intended, say so in the docs; otherwise match the other gates. (2) It bypasses the use_custom_cublas_mm branch below, which emits the output in an NCCL symmetric-memory window when module.all_reduce.uses_nccl_symmetric_memory_window() is true (strategies NCCL/NCCL_SYMMETRIC/AUTO with zero-copy on). The deterministic branch in ops.py only intercepts strategy == NCCL, so under AUTO or NCCL_SYMMETRIC the allreduce now receives a default buffer where it expected a window buffer. Please confirm that path falls back cleanly, or add not (getattr(module, 'all_reduce', None) and module.all_reduce.uses_nccl_symmetric_memory_window()) to this gate.

In the C++ runner -1 resolves to profiles.front() (setRunnerProfiles in moeOp.cpp), i.e. whichever tactic happens to head the generated CUTLASS list, and _resolve_fallback_tactic remaps it to the last profile on SM107. So the arithmetic is fixed within one build but can change when the tactic list is regenerated or reordered. Worth stating in this comment, and worth a perf number in the PR description: the first tactic is not tuned for either prefill or decode shapes.

Each program handles one (query, head, sequence) and walks the whole KV prefix in 32-token blocks with scalar FP32 dot products, so a prefill of length L costs O(L²/32) serial iterations per head with no tensor-core use. That is the documented tradeoff, but it is steep enough (minutes for a 32k prompt) that the attention.md section should give an order-of-magnitude number, and the executor should probably refuse or warn when max_num_tokens is large with this library selected. A cheap improvement that keeps the per-query reduction order fixed: process a tile of queries per program sharing the K/V loads.

_recurrent_update reads the initial state unconditionally from ssm_states[state_indices_p] and ignores has_initial_states; this is only correct because reset_recurrent_state_rows zeroed fresh slots in forward_core (the verify path has a comment saying so). Add the same precondition comment here, since this branch is the first non-verify prefill path to depend on it, and a future caller of forward_extend that skips forward_core would silently reuse stale state.
